Abstract

The rapid evolution of cyber threats has exposed significant limitations in conventional signature-based security systems, particularly their dependence on previously identified attack patterns and predefined detection rules. The increasing sophistication of malware, zero-day vulnerabilities, advanced persistent threats, ransomware, phishing, and polymorphic attacks requires intelligent security mechanisms capable of identifying previously unseen malicious activities. Deep learning has emerged as a promising approach for advanced cyber threat detection because it enables automated feature extraction, behavioral analysis, anomaly identification, and classification of complex network activities. This research examines the application of deep neural networks, convolutional neural networks, recurrent neural networks, long short-term memory networks, and autoencoders in developing adaptive cybersecurity architectures. The study proposes a hybrid deep learning framework that integrates supervised classification with unsupervised anomaly detection to identify known and unknown cyber threats. An experimental evaluation framework is developed using the UNSW-NB15 and CICIDS2017 benchmark datasets, incorporating data preprocessing, feature normalization, class balancing, model training, and performance assessment. The evaluation considers accuracy, precision, recall, F1-score, false positive rate, and detection latency to examine the effectiveness of intelligent threat detection. The research further discusses adversarial robustness, explainability, computational efficiency, and deployment challenges associated with deep learning-based security systems. The proposed approach establishes a conceptual foundation for transitioning from reactive signature matching toward behavior-oriented, data-driven, and continuously adaptive cyber defense mechanisms.
